How to Check the Quality of Labeled AI Data Before You Scale
Labels set the ceiling for what a model can learn. Five checks for label quality, why to start with a pilot and what to ask a labeling vendor before you hire.
Labels Set the Ceiling for the Model
The labels you train on set the ceiling for what your model can learn. Yet many teams judge a labeling vendor on speed and price alone, and find the quality problem only after the model underperforms. Ask how quality is checked before the first batch, not after the last one.
Five Checks That Work
1. A written labeling guide with examples of right and wrong. If two people read it and label differently, the guide is the problem, not the people. 2. A gold set: items with known answers, mixed into the work to check each labeler. 3. Review passes: a second person checks a sample, or every item for hard cases. 4. An agreement score: how often labelers choose the same label, and what happens when they do not. 5. A feedback loop: every error becomes a clearer line in the guide. A vendor who cannot show you these has only one way to check quality, which is to look at the final result.
Start With a Pilot
Do not hand over 100,000 images on day one. A pilot batch of a few hundred items shows you the quality and shows whether your guide is clear. It costs little next to a large batch that has to be redone. A pilot also tells you early whether the vendor reads your instructions and follows them.
Questions to Ask Before You Hire
A good company will answer these without hurry. 1. Will you sign an NDA before we share any file? 2. Who will label our data, and do they know our field? 3. Can we see a sample quality report? 4. Which formats do you deliver, such as COCO, YOLO or KITTI? 5. How do you handle personal data, such as faces and voices? 6. What happens if our guide changes halfway through?
In-House or Outsourced?
Labeling in-house gives you control but pulls engineers off the product. Outsourcing frees your team and scales up and down. Many teams label a small gold set themselves and outsource the volume. That keeps the definition of a correct label in your hands while someone else does the repetitive work.
Frequently asked questions
What is a gold set in data labeling?
A gold set is a group of items with known correct answers. It is mixed into the work to check each labeler against the truth and to show who needs more guidance.
How big should a labeling pilot be?
A few hundred items is usually enough to see the quality and to find the unclear lines in your guide. The right size depends on how many label types you have, so ask the vendor to suggest one after seeing a sample.
What is the difference between data labeling and data annotation?
In practice the terms mean the same thing. Some people use annotation for richer work such as outlines and 3D boxes, and labeling for simpler tags. Compare the task, not the word.
Should we label our data in-house or outsource it?
In-house gives you control but takes engineer time from the product. Many teams label a small gold set themselves and outsource the volume.
Want to see our label quality first?
Our AI data team labels images, video, 3D LiDAR point clouds and speech for AI teams, under NDA, with a pilot first. Tell us the data type, the volume and how detailed the labels must be, and we quote after seeing a sample.
